A new research paper, "Federated Learning and Unlearning for Recommendation with Personalized Data Sharing," introduces FedShare, a novel framework designed to solve a critical tension in modern recommender systems: the trade-off between user privacy and model performance.
Traditional Federated Recommender Systems (FedRS) operate on a strict principle: all user interaction data (e.g., clicks, views, purchases) must remain on the user's local device. A global model is trained by aggregating model updates from these devices without ever centralizing the raw data. This protects privacy but often results in lower recommendation accuracy, as the server cannot leverage a rich, centralized dataset to understand complex user-item relationships.
FedShare challenges the "one-size-fits-all" privacy assumption. It recognizes that user privacy preferences are personalized and dynamic. Some users may be willing to share a portion of their data with a central server if it meaningfully improves the recommendations they receive. Crucially, they may also later change their minds and request that their shared data be "unshared"—not just deleted from a database, but for its influence to be removed from the already-trained global model. Existing systems struggle with this latter requirement, known as machine unlearning.
Technical Details
FedShare is a federated learn-unlearn framework with two core phases:
The Learning Phase with Personalized Sharing: Users can choose how much of their local interaction data to share with the central server. FedShare uses this shared subset to construct a server-side, high-order user-item graph. This graph captures complex relationships (e.g., users who like A and B also like C) that are difficult to infer from isolated local data. The framework then uses contrastive learning to align the representations learned from a user's private local data with the richer representations derived from the global shared graph. This hybrid approach aims to give users who share data the benefit of improved recommendations without compromising the privacy of those who do not.
The Unlearning Phase: This is FedShare's key innovation. When a user requests to "unshare" previously contributed data, the system must efficiently remove that data's influence from the global model. Retraining from scratch is prohibitively expensive. Existing federated unlearning methods often require storing large amounts of historical gradient information, creating massive storage overhead.
FedShare's contrastive unlearning mechanism sidesteps this. It uses a small number of historical embedding snapshots (recorded during training) to selectively identify and remove only the representation components influenced by the to-be-unshared data. The authors claim this method significantly reduces the storage cost of supporting unlearning requests while maintaining model performance.
According to the paper, extensive experiments on three public datasets show FedShare achieves strong recommendation accuracy in both learning and unlearning phases, with a significantly lower storage footprint during unlearning compared to state-of-the-art baselines.

FedShare provides a technically feasible path for a brand to comply with a client's request to have their shared data removed and its influence erased from recommendation models. This is critical for maintaining regulatory compliance and consumer trust in a sector handling highly sensitive financial and lifestyle data.
Enabling Dynamic Consent Models: A client's willingness to share data may change. They might share data during a active shopping period but retract it later. FedShare’s framework natively supports this fluidity, allowing brands to design more nuanced and respectful data consent interfaces that don't lock users into a single, static choice.
Practical Application Scenario: Imagine a luxury fashion app. A user could adjust a slider: "Share my data to improve recommendations for everyone." If set to 50%, half their anonymized interactions help build a better global trend model. They receive better outfit suggestions because the server model understands how their taste (learned locally) aligns with global patterns. If they later buy a highly private gift and move the slider to 0%, FedShare would efficiently unlearn their previously shared interactions, ensuring that gift doesn't indirectly influence future recommendations for them or others.
